본 논문에서는 IEC 61850 기반 자동화 변전소 네트워크에서의 이상 징후 탐지를 위한 MMS/GOOSE 패킷 정상행위 프로파일링 방법을 제안한다. 기존에 주로 사용되고 있는 시그니처(signature) 기반의 보안 솔루션은 제로데이(zero-day) 취약점을 이용한 APT 공격에 취약에 취약할 수밖에 없다. 최근 제어시스템 환경에서의 이상 탐지(anomaly detection) 연구가 이뤄지고 있지만, 아직까지 IEC 61850 변전소 환경에서의 이상 탐지에 대한 연구는 잘 알려져 있지 않다. 제안하는 기법은 MMS/GOOSE 패킷에 대한 3가지 전처리(3-phase preprocessing) 방법과 one-class SVM 알고리즘을 이용한 정상 행위 모델링 방법을 포함한다. 본 논문에서 제시하는 방법은 IEC 61850 변전소 네트워크에 대한 APT 공격 대응 솔루션으로 활용될 것을 기대한다.
최근에는 대부분의 인터넷 공격은 악성코드(Malware)에 의한 잘 알려지지 않은 제로데이 공격 형태가 주류를 이루고 있으며, 이미 알려진 공격유형들에 대해서 탐지하는 오용탐지 기술로는 이러한 공격에 대응하기가 어려운 실정이다. 또한, 다양한 공격 패턴들이 인터넷상에 나타나고 있기 때문에 기존의 정보 보호 기술로는 한계에 다다르게 되었고, 웹기반 서비스가 보편화됨에 따라 인터넷상에 노출된 웹 서비스가 주공격 대상이 되고 있다. 본 논문은 인터넷상의 트래픽 유형을 분류하고, 각 유형에 따른 이상 징후를 탐지하고 분석할 수 있는 비정상행위공격 탐지기술(Anomaly Intrusion Detection Technologies)을 포함하고 있는 위협관리 시스템(Threat Management System)을 제안한다.
오토인코더 딥러닝 모델은 이상 데이터도 정상 데이터로 복원하는 능력이 우수하여 이상탐지에 적절하지 못한 경우가 발생한다. 그리고 데이터의 일부를 가린(마스킹) 후 가린 데이터를 복원하는 방식인 Inpainting 방식은 잡음이 많은 이미지에 대해서는 복원능력이 떨어지는 문제점을 가지고 있다. 본 논문에서는 MLP-Mixer 모델을 수정·개선하여 이미지를 일정 비율로 마스킹하고 마스킹된 이미지의 압축된 정보를 모델에 전달해 이미지를 재구성하는 방식을 사용하였다. MVTec AD 데이터 셋의 정상 데이터로 학습한 모델을 구축한 뒤, 정상과 이상 이미지를 각각 입력하여 재구성 오류를 구하고 이를 통해 이상탐지를 수행하였다. 성능 평가 결과 제안된 방식이 기존의 방식에 비해 이상탐지 성능이 우수한 것으로 나타났다.

The high-flux advanced neutron application reactor (HANARO) is a multi-purpose research reactor at the Korea Atomic Energy Research Institute (KAERI). HANARO has been used in scientific and industrial research and developments. Therefore, stable operation is necessary for national science and industrial prospects. This study proposed an anomaly detection system based on deep learning, that supports the stable operation of HANARO. The proposed system collects multiple sensor data, displays system information, analyzes status, and performs anomaly detection using deep autoencoder. The system comprises communication, visualization, and anomaly-detection modules, and the prototype system is implemented on site in 2021. Finally, an analysis of the historical data and synthetic anomalies was conducted to verify the overall system; simulation results based on the historical data show that 12 cases out of 19 abnormal events can be detected in advance or on time by the deep learning AD model.
Anomaly detection holds paramount significance across diverse fields, encompassing fraud detection, risk mitigation, and sensor evaluation tests. Its pertinence extends notably to the military, particularly within the Warrior Platform, a comprehensive combat equipment system with wearable sensors. Hence, we propose a data-compression-based anomaly detection approach tailored to unlabeled time series and sequence data. This method entailed the construction of two distinctive features, typicality and atypicality, to discern anomalies effectively. The typicality of a test sequence was determined by evaluating the compression efficacy achieved through the pattern dictionary. This dictionary was established based on the frequency of all patterns identified in a training sequence generated for each sensor within Warrior Platform. The resulting typicality served as an anomaly score, facilitating the identification of anomalous data using a predetermined threshold. To improve the performance of the pattern dictionary method, we leveraged atypicality to discern sequences that could undergo compression independently without relying on the pattern dictionary. Consequently, our refined approach integrated both typicality and atypicality, augmenting the effectiveness of the pattern dictionary method. Our proposed method exhibited heightened capability in detecting a spectrum of unpredictable anomalies, fortifying the stability of wearable sensors prevalent in military equipment, including the Army TIGER 4.0 system.
Deep learning-based computer vision anomaly detection algorithms are widely utilized in various fields. Especially in the manufacturing industry, the difficulty in collecting abnormal data compared to normal data, and the challenge of defining all potential abnormalities in advance, have led to an increasing demand for unsupervised learning methods that rely on normal data. In this study, we conducted a comparative analysis of deep learning-based unsupervised learning algorithms that define and detect abnormalities that can occur when transparent contact lenses are immersed in liquid solution. We validated and applied the unsupervised learning algorithms used in this study to the existing anomaly detection benchmark dataset, MvTecAD. The existing anomaly detection benchmark dataset primarily consists of solid objects, whereas in our study, we compared unsupervised learning-based algorithms in experiments judging the shape and presence of lenses submerged in liquid. Among the algorithms analyzed, EfficientAD showed an AUROC and F1-score of 0.97 in image-level tests. However, the F1-score decreased to 0.18 in pixel-level tests, making it challenging to determine the locations where abnormalities occurred. Despite this, EfficientAD demonstrated excellent performance in image-level tests classifying normal and abnormal instances, suggesting that with the collection and training of large-scale data in real industrial settings, it is expected to exhibit even better performance.
We propose a general framework for keyed learning, where a secret key is used as an additional input of an adversarial learning system. We also define models and formal challenges for an adversary who knows the learning algorithm and its input data but has no access to the key value. This adversarial learning framework is subsequently applied to a more specific context of anomaly detection, where the secret key finds additional practical uses and guides the entire learning and alarm-generating procedure.
시스템이 다양화 되면서 동시에 저장된 로그도 다양하게 분석할 필요가 생겼다. 이러한 로그 데이터 분석에 관한 필요성이 강해지는 환경이 시간 순으로 발생하는 이벤트 단위의 로그로부터 프로세스 모델을 도출하고, 시스템을 개선시키는 활동에 이바지하도록 요구하고 있다. 기존에는 개별 이벤트 단위의 로그를 분석하면서 속성들의 관계를 파악하는 연구가 활발했다. 본 논문에서는 로그 데이터를 활용한 예외적인 형태의 프로세스 인스턴스를 판별하는 방법으로 LAPID(Local Anomaly Process Instance Detection)를 제안한다. LAPID는 액티비티-릴레이션 매트릭스(Activity relation matrix)를 사용해서 계산된 거리 값을 활용하여, API(Anomaly Process Instance)를 탐색한다. 제시한 방법의 유용성을 검증하기 위하여 항만 물류에서 발생하는 컨테이너 이동에 대한 트레이스(Trace)를 포함하는 로그 데이터에서 예외적인 상황의 프로세스 실행이 가지는 특징을 도출하였다. 이를 위하여 본 논문에서는 국내의 실제 항만에서 발생한 이벤트 로그를 이용하여 사례연구를 수행하였다.
공격자의 무기가 점차 지능화 및 고도화되고 있어 기존 백신만으로는 보안 사고를 막을 수 없으므로 endpoint까지 보안 위협이 검토되고 있다. 최근 endpoint를 보호하기 위한 EDR 보안 솔루션이 등장했지만, 가시성에 중점을 두고 있으며, 이에 대한 탐지 및 대응 기술은 부족하다. 본 논문에서는 보안 관리자 관점에서 효과적인 분석과 분석 대상을 선별하기 위해 실 환경 EDR 이벤트 로그를 사용하여 지식 기반 MITRE ATT&CK 및 AutoEncoder 기반 Anomaly Detection 기술을 종합적으로 사용하여 이상 공격징후를 탐지한다. 이후, 탐지된 이상 공격징후는 보안 관리자에게 로그정보와 함께 alarm을 보여주며, 레거시 시스템과의 연계가 가능하다. 실험은 5일에 대한 EDR 이벤트 로그를 하루 단위로 탐지했으며, Hybrid Analysis 검색을 통해 이를 검증한다. 따라서, EDR 이벤트 로그 기반 언제, 어떤 IP에서, 어떤 프로세스가 얼마나 의심스러운지에 대한 결과를 산출하며, 산출된 의심 IP/Process에 대한 조치를 통해 안전한 endpoint 환경을 조성할 것으로 기대한다.
머신러닝과 딥러닝의 기술이 보편화되면서 산업제어시스템의 이상(비정상) 탐지 연구에도 적용이 되기 시작하였다. 국내에서는 산업제어시스템의 이상 탐지를 위한 인공지능 연구를 활성화시키기 위하여 HAI 데이터셋을 개발하여 공개하였고, 산업제어시스템 보안위협 탐지 AI 경진대회를 시행하고 있다. 이상 탐지 연구들은 대개 기존의 딥러닝 학습 알고리즘을 변형하거나 다른 알고리즘과 함께 적용하는 앙상블 학습 모델의 방법을 통해 향상된 성능의 학습 모델을 만드는 연구가 대부분 이었다. 본 연구에서는 학습 모델과 데이터 전처리(pre-processing)의 개선을 통한 방법이 아니라, 비정상 데이터를 탐지하여 라벨링 한 결과를 보정하는 후처리(post-processing) 방법으로 이상 탐지의 성능을 개선시키는 연구를 진행하였고, 그 결과 기존 모델의 이상 탐지 성능 대비 약 10%이상의 향상된 결과를 확인하였다.
