Anomaly detection in human movements can improve safety in indoor workplaces. In this paper, we design a framework for detecting anomalous trajectories of humans in indoor spaces based on a variational autoencoder (VAE) with Bi-LSTM layers. First, the VAE is trained to capture the latent representation of normal trajectories. Then the abnormality of a new trajectory is checked using the trained VAE. In this step, the anomaly score of the trajectory is determined using the trajectory reconstruction error through the VAE. If the anomaly score exceeds a threshold, the trajectory is detected as an anomaly. To select the anomaly threshold, a new metric called D-score is proposed, which measures the difference between recall and precision. The anomaly threshold is selected according to the minimum value of the D-score on the validation set. The MIT Badge dataset, which is a real trajectory dataset of workers in indoor space, is used to evaluate the proposed framework. The experiment results show that our framework effectively identifies abnormal trajectories with 81.22% in terms of the F1-score.
The health of the human heart is commonly measured using ECG (Electrocardiography) signals. To identify any anomaly in the human heart, the time-sequence of ECG signals is examined manually by a cardiologist or cardiac electrophysiologist. Lightweight anomaly detection on ECG signals in an embedded system is expected to be popular in the near future, because of the increasing number of heart disease symptoms. Some previous research uses deep learning networks such as LSTM and BiLSTM to detect anomaly signals without any handcrafted feature. Unfortunately, lightweight LSTMs show low precision and heavy LSTMs require heavy computing powers and volumes of labeled dataset for symptom classification. This paper proposes an ECG anomaly detection system based on two level BiLSTM for acceptable precision with lightweight networks, which is lightweight and usable at home. Also, this paper presents a new threshold technique which considers statistics of the current ECG pattern. This paper's proposed model with BiLSTM detects ECG signal anomaly in 0.467 ~ 1.0 F1 score, compared to 0.426 ~ 0.978 F1 score of the similar model with LSTM except one highly noisy dataset.
코로나19의 펜데믹 현상으로 인하여 모바일 서비스의 활용 비중이 높아지고 있다. 그러나, 대부분의 모바일 장비에 대한 이상 현상을 장비의 알람 중심으로 인지하므로, 복잡한 장애가 발생할 경우에 직관적으로 장비의 문제 판별하기 어려운 한계가 발생한다. 이를 보완하기 위해서 본 연구에서는 장비의 알람과 성능 정보를 조합하여 직관적으로 문제를 인지할 수 있도록 RRCF 알고리즘을 활용하여 Anomaly Score 생성하였으며, 과거 장애 이력을 97% 검출하는 효과를 검증하였다.
에너지 사용량의 증가와 친환경 정책으로 인해 건물 에너지를 효율적으로 소비할 필요가 있으며, 이를 위해 딥러닝 기반 이상 전력 탐지가 수행되고 있다. 수집이 어려운 이상치 데이터의 특징으로 인해 Recurrent Neural Network(RNN) 기반 오토인코더를 활용한 복원 에러 기반으로 이상 탐지가 수행되고 있으나, 시계열 특징을 온전히 학습하는데 시간이 오래 걸리고 학습 데이터의 노이즈에 민감하다는 단점이 있다. 본 논문에서는 이러한 한계를 극복하기 위해 Temporal Convolutional Network(TCN)과 UnSupervised Anomaly Detection for multivariate time series(USAD)를 결합한 TCN-USAD를 제안한다. 제안된 모델은 TCN 기반 오토인코더와 두 개의 디코더와 적대적 학습을 사용하는 USAD 구조를 활용하여 빠르게 시계열 특징을 온전히 학습할 수 있고 강건한 이상 탐지가 가능하다. TCN-USAD의 성능을 입증하기 위해 2개의 건물 전력 사용량 데이터 세트를 사용하여 비교 실험을 수행한 결과, TCN 기반 오토인코더는 RNN 기반 오토 인코더 대비 빠르고 복원 성능이 우수하였으며, 이를 활용한 TCN-USAD는 다른 이상 탐지 모델 대비 약 20% 개선된 F1-Score를 달성하여 뛰어난 이상 탐지 성능을 보였다.
Deep learning-based computer vision anomaly detection algorithms are widely utilized in various fields. Especially in the manufacturing industry, the difficulty in collecting abnormal data compared to normal data, and the challenge of defining all potential abnormalities in advance, have led to an increasing demand for unsupervised learning methods that rely on normal data. In this study, we conducted a comparative analysis of deep learning-based unsupervised learning algorithms that define and detect abnormalities that can occur when transparent contact lenses are immersed in liquid solution. We validated and applied the unsupervised learning algorithms used in this study to the existing anomaly detection benchmark dataset, MvTecAD. The existing anomaly detection benchmark dataset primarily consists of solid objects, whereas in our study, we compared unsupervised learning-based algorithms in experiments judging the shape and presence of lenses submerged in liquid. Among the algorithms analyzed, EfficientAD showed an AUROC and F1-score of 0.97 in image-level tests. However, the F1-score decreased to 0.18 in pixel-level tests, making it challenging to determine the locations where abnormalities occurred. Despite this, EfficientAD demonstrated excellent performance in image-level tests classifying normal and abnormal instances, suggesting that with the collection and training of large-scale data in real industrial settings, it is expected to exhibit even better performance.
본 논문은 전문가 독립적 비지도 신경망 학습 기반 다변량 시계열 데이터 분석 모델인 MSCRED(Multi-Scale Convolutional Recurrent Encoder-Decoder)의 실제 현장에서의 적용과 Auto-encoder 기반인 MSCRED 모델의 한계인, 학습 데이터가 오염되지 않아야 된다는 점을 극복하기 위한 학습 데이터 샘플링 기법인 Subset Sampling Validation을 제시한다. 라벨 분류가 되어있는 발전소 장비의 진동 데이터를 이용하여 1) 학습 데이터에 비정상 데이터가 섞여 있는 상황을 재현하고, 이를 학습한 경우 2) 1과 같은 상황에서 Subset Sampling Validation 기법을 통해 학습 데이터에서 비정상 데이터를 제거한 경우의 Anomaly Score를 비교하여 MSCRED와 Subset Sampling Validation 기법을 유효성을 평가한다. 이를 통해 본 논문은 전문가 독립적이며 오류 데이터에 강한 이상 진단 프레임워크를 제시해, 다양한 다변량 시계열 데이터 분야에서의 간결하고 정확한 해결 방법을 제시한다.
최근 컴퓨팅 기술의 발전과 클라우드 환경의 개선에 따라 딥 러닝 기술이 발전하게 되었으며, 다양한 분야에 딥 러닝을 적용하려는 시도가 많아지고 있다. 대표적인 예로 정상적인 데이터에서 벗어나는 값이나 패턴을 식별하는 기법인 이상 탐지가 있으며, 이상 탐지의 대표적 유형인 점 이상, 집단적 이상, 맥락적 이중 특히 전반적인 상황을 파악해야 하는 맥락적 이상을 탐지하는 것은 매우 어려운 것으로 알려져 있다. 일반적으로 이미지 데이터의 이상 상황 탐지는 대용량 데이터로 학습된 사전학습 모델을 사용하여 이루어진다. 하지만 이러한 사전학습 모델은 이미지의 객체 클래스 분류에 초점을 두어 생성되었기 때문에, 다양한 객체들이 만들어내는 복잡한 상황을 탐지해야 하는 이상 상황 탐지에 그대로 적용되기에는 한계가 있다. 이에 본 연구에서는 객체 클래스 분류를 학습한 사전학습 모델을 기반으로 이미지 캡셔닝 학습을 추가적으로 수행하여, 객체 파악뿐만 아니라 객체들이 만들어내는 상황까지 이해해야 하는 이상 상황 탐지에 적절한 2 단계 사전학습 모델 구축 방법론을 제안한다. 구체적으로 제안 방법론은 ImageNet 데이터로 클래스 분류를 학습한 사전학습 모델을 이미지 캡셔닝 모델에 전이하고, 이미지가 나타내는 상황을 설명한 캡션을 입력 데이터로 사용하여 학습을 진행한다. 이후 이미지와 캡션을 통해 상황 특질을 학습한 가중치를 추출하고 이에 대한 미세 조정을 수행하여 이상 상황 탐지 모델을 생성한다. 제안 방법론의 성능을 평가하기 위해 직접 구축한 데이터 셋인 상황 이미지 400장에 대해 이상 탐지 실험을 수행하였으며, 실험 결과 제안 방법론이 기존의 단순 사전학습 모델에 비해 이상 상황 탐지 정확도와 F1-score 측면에서 우수한 성능을 나타냄을 확인하였다.
Anomaly detection holds paramount significance across diverse fields, encompassing fraud detection, risk mitigation, and sensor evaluation tests. Its pertinence extends notably to the military, particularly within the Warrior Platform, a comprehensive combat equipment system with wearable sensors. Hence, we propose a data-compression-based anomaly detection approach tailored to unlabeled time series and sequence data. This method entailed the construction of two distinctive features, typicality and atypicality, to discern anomalies effectively. The typicality of a test sequence was determined by evaluating the compression efficacy achieved through the pattern dictionary. This dictionary was established based on the frequency of all patterns identified in a training sequence generated for each sensor within Warrior Platform. The resulting typicality served as an anomaly score, facilitating the identification of anomalous data using a predetermined threshold. To improve the performance of the pattern dictionary method, we leveraged atypicality to discern sequences that could undergo compression independently without relying on the pattern dictionary. Consequently, our refined approach integrated both typicality and atypicality, augmenting the effectiveness of the pattern dictionary method. Our proposed method exhibited heightened capability in detecting a spectrum of unpredictable anomalies, fortifying the stability of wearable sensors prevalent in military equipment, including the Army TIGER 4.0 system.
To train deep learning algorithms, a sufficient number of data are required. However, in most engineering systems, the acquisition of fault data is difficult or sometimes not feasible, while normal data are secured. The dearth of data is one of the major challenges to developing deep learning models, and fault diagnosis in particular cannot be made in the absence of fault data. With this context, this paper proposes an anomaly detection methodology for rotating machines using only normal data with self-labeling. Since only normal data are used for anomaly detection, a self-labeling method is used to generate a new labeled dataset. The overall procedure includes the following three steps: (1) transformation of normal data to self-labeled data based on a pretext task, (2) training the convolutional neural networks (CNN), and (3) anomaly detection using defined anomaly score based on the softmax output of the trained CNN. The softmax value of the abnormal sample shows different behavior from the normal softmax values. To verify the proposed method, four case studies were conducted, on the Case Western Reserve University (CWRU) bearing dataset, IEEE PHM 2012 data challenge dataset, PHMAP 2021 data challenge dataset, and laboratory bearing testbed; and the results were compared to those of existing machine learning and deep learning methods. The results showed that the proposed algorithm could detect faults in the bearing testbed and compressor with over 99.7% accuracy. In particular, it was possible to detect not only bearing faults but also structural faults such as unbalance and belt looseness with very high accuracy. Compared with the existing GAN, the autoencoder-based anomaly detection algorithm, the proposed method showed high anomaly detection performance.
본 논문에서는 베어링의 결함 진단을 위한 단일 클래스 분류의 진동 이상 탐지 시스템을 제안한다. 베어링 고장으로 인해 발생하는 경제적 및 시간적 손실을 줄이기 위해 정확한 결함 진단시스템은 필수적이며 문제 해결을 위해 딥러닝 기반의 결함 진단 시스템들이 널리 연구되고 있다. 그러나 딥러닝 학습을 위한 실제 데이터 채집 환경에서 비정상 데이터 확보에 어려움이 있으며 이는 데이터 편향을 초래한다. 이에 정상 데이터만 활용하는 단일 클래스 분류 방법을 활용한다. 일반적인 방법으로는 AutoEncoder를 통한 압축과 복원 과정을 학습하여 진동 데이터의 특성을 추출한다. 추출된 특성으로 단일 클래스 분류기를 학습하여 이상 탐지를 실시한다. 하지만 이와 같은 방법은 진동 데이터의 주파수 특성을 고려하지 않아서 진동 데이터의 특성을 효율적 추출할 수 없다. 이러한 문제를 해결하기 위해 진동 데이터의 주파수 특성을 고려한 AutoEncoder 모델을 제안한다. 분류 성능은 accuracy 0.910, precision 1.0, recall 0.820, f1-score 0.901이 나왔다. 주파수 특성을 고려한 네트워크 설계로 기존 방법들보다 우수한 성능을 확인하였다.
