The Prediction and Trading Strategy for Intraday Stock Price Movements: A Deep Learning Approach (딥러닝을 이용한 Intraday 주가 예측 및 매매전략)

  • 본 연구는 국내 주식의 intraday 가격변화를 딥러닝 모형들로 예측하고 그 예측모형을 이용한 매매전략 딥러닝 모형을 제안한다. 주식의 intraday 가격변화에 따라서, 고빈도 매매, 주문집행문제 (order execution problem), 자동화 매매 등과 같은 intraday 주식 트레이딩의 수익률이 달라지기 때문에, 주식의 intraday 가격변화 예측은 주식 투자에 있어서 중요하다. 해외 시장에 대해서는 인공지능 등을 이용한 intraday 가격변화 예측 연구가 활발히 이루어졌지만, 국내의 경우 관련한 연구가 드물어 그 효용성이 명확히 드러나지 않았었다. 그에 따라서, KOSPI 50의 구성 종목에 대하여 정준의(canonical) 딥러닝 모형들을 적용하여 예측 성능을 비교한다. 또한, 그 예측모형들을 활용하여 간소화된 주문집행문제에서의 매매전략 딥러닝 모형을 제안한다. 그리고, 제안한 매매전략 딥러닝 모형을 KOSPI 50의 구성 종목에 대하여 실험하여, 제안한 방법론이 유효함을 밝힌다. 제시된 모형을 실제 주식 매매에 직접 적용하여 수익성을 개선을 기대할 수 있고, 사람이 직접 거래할지라도 효과적인 보조 지표가 될 수 있기에 본 논문은 실용적 의미를 지닌다.

A Time Series Graph based Convolutional Neural Network Model for Effective Input Variable Pattern Learning : Application to the Prediction of Stock Market (효과적인 입력변수 패턴 학습을 위한 시계열 그래프 기반 합성곱 신경망 모형: 주식시장 예측에의 응용)

  • Over the past decade, deep learning has been in spotlight among various machine learning algorithms. In particular, CNN(Convolutional Neural Network), which is known as the effective solution for recognizing and classifying images or voices, has been popularly applied to classification and prediction problems. In this study, we investigate the way to apply CNN in business problem solving. Specifically, this study propose to apply CNN to stock market prediction, one of the most challenging tasks in the machine learning research. As mentioned, CNN has strength in interpreting images. Thus, the model proposed in this study adopts CNN as the binary classifier that predicts stock market direction (upward or downward) by using time series graphs as its inputs. That is, our proposal is to build a machine learning algorithm that mimics an experts called 'technical analysts' who examine the graph of past price movement, and predict future financial price movements. Our proposed model named 'CNN-FG(Convolutional Neural Network using Fluctuation Graph)' consists of five steps. In the first step, it divides the dataset into the intervals of 5 days. And then, it creates time series graphs for the divided dataset in step 2. The size of the image in which the graph is drawn is $40(pixels){\times}40(pixels)$, and the graph of each independent variable was drawn using different colors. In step 3, the model converts the images into the matrices. Each image is converted into the combination of three matrices in order to express the value of the color using R(red), G(green), and B(blue) scale. In the next step, it splits the dataset of the graph images into training and validation datasets. We used 80% of the total dataset as the training dataset, and the remaining 20% as the validation dataset. And then, CNN classifiers are trained using the images of training dataset in the final step. Regarding the parameters of CNN-FG, we adopted two convolution filters ($5{\times}5{\times}6$ and $5{\times}5{\times}9$) in the convolution layer. In the pooling layer, $2{\times}2$ max pooling filter was used. The numbers of the nodes in two hidden layers were set to, respectively, 900 and 32, and the number of the nodes in the output layer was set to 2(one is for the prediction of upward trend, and the other one is for downward trend). Activation functions for the convolution layer and the hidden layer were set to ReLU(Rectified Linear Unit), and one for the output layer set to Softmax function. To validate our model - CNN-FG, we applied it to the prediction of KOSPI200 for 2,026 days in eight years (from 2009 to 2016). To match the proportions of the two groups in the independent variable (i.e. tomorrow's stock market movement), we selected 1,950 samples by applying random sampling. Finally, we built the training dataset using 80% of the total dataset (1,560 samples), and the validation dataset using 20% (390 samples). The dependent variables of the experimental dataset included twelve technical indicators popularly been used in the previous studies. They include Stochastic %K, Stochastic %D, Momentum, ROC(rate of change), LW %R(Larry William's %R), A/D oscillator(accumulation/distribution oscillator), OSCP(price oscillator), CCI(commodity channel index), and so on. To confirm the superiority of CNN-FG, we compared its prediction accuracy with the ones of other classification models. Experimental results showed that CNN-FG outperforms LOGIT(logistic regression), ANN(artificial neural network), and SVM(support vector machine) with the statistical significance. These empirical results imply that converting time series business data into graphs and building CNN-based classification models using these graphs can be effective from the perspective of prediction accuracy. Thus, this paper sheds a light on how to apply deep learning techniques to the domain of business problem solving.

  • The Objective of the study was to determine the usefulness of human resource accounting(HRA) information in assisting financial analysis in their investment decisions. The objective achieved by an investigation through which the reporting of HRA, combined with demographic factors that are independent or interactive, affects the decisions of financial analysts regarding the estimation of the market price of a hypothetical company's common stocks. Two kinds of research were conducted to increase the reliability of the study at the same time. Two or three sets of financial statement were prepared. Each consists of balance sheet and income statement. The actual financial statement was modified to exclude personal bias and opinion.

The Timely Disclosure Behaviors of Delisted Companies: An Empirical Study of Korean Firms

  • The involuntary delisting of public companies has a detrimental effect on economies caused by the loss of stock value and confidence in the capital market. Previous studies have focused on prediction or prevention models for firm delisting events using various financial and accounting information. However, the timely disclosure of companies, another important indicator, has not been investigated before in connection with companies that have been delisted. To address this gap, this study investigates the timely disclosure behavior of companies prior to delisting using sample firms listed on the Korean stock market between 2000 and 2014. The results show a significant correlation between the frequency of timely disclosure and delisted firms prior to their delisting on the Korean stock market. The delisted companies appear to increase their timely disclosure to deliver specific information to the public. Furthermore, these companies are likely to increase the frequency of timely disclosure as they get closer to their delisting. Notably, the timely disclosure of delisted firms has a capital market effect; namely, timely disclosure increases trading volume while decreasing the market value of the shares, reflecting price efficiency. This study appears to be the first that considers timely disclosure in the involuntary delisting literature.

Predicting The Direction of The Daily KOSPI Movement Using Neural Networks For ETF Trades (신경회로망을 이용한 일별 KOSPI 이동 방향 예측에 의한 ETF 매매)

  • Neural networks have been used to predict the direction of stock index movement from past data. The conventional research that predicts the upward or downward movement of the stock index predicts a rise or fall even with small changes in the index. It is highly likely that losses will occur when trading ETFs by use of the prediction. In this paper, a neural network model that predicts the movement direction of the daily KOrea composite Stock Price Index (KOSPI) to reduce ETF trading losses and earn more than a certain amount per trading is presented. The proposed model has outputs that represent rising (change rate in index ${\geq}{\alpha}$), falling (change rate ${\leq}-{\alpha}$) and neutral ($-{\alpha}$ change rate < ${\alpha}$). If the forecast is rising, buy the Leveraged Exchange Traded Fund (ETF); if it is falling, buy the inverse ETF. The hit ratio (HR) of PNN1 implemented in this paper is 0.720 and 0.616 in the learning and the evaluation respectively. ETF trading yields a yield of 8.386 to 16.324 %. The proposed models show the better ETF trading success rate and yield than the neural network models predicting KOSPI.

Developing the Automated Sentiment Learning Algorithm to Build the Korean Sentiment Lexicon for Finance (재무분야 감성사전 구축을 위한 자동화된 감성학습 알고리즘 개발)

  • Recently, many studies are being conducted to extract emotion from text and verify its information power in the field of finance, along with the recent development of big data analysis technology. A number of prior studies use pre-defined sentiment dictionaries or machine learning methods to extract sentiment from the financial documents. However, both methods have the disadvantage of being labor-intensive and subjective because it requires a manual sentiment learning process. In this study, we developed a financial sentiment dictionary that automatically extracts sentiment from the body text of analyst reports by using modified Bayes rule and verified the performance of the model through a binary classification model which predicts actual stock price movements. As a result of the prediction, it was found that the proposed financial dictionary from this research has about 4% better predictive power for actual stock price movements than the representative Loughran and McDonald's (2011) financial dictionary. The sentiment extraction method proposed in this study enables efficient and objective judgment because it automatically learns the sentiment of words using both the change in target price and the cumulative abnormal returns. In addition, the dictionary can be easily updated by re-calculating conditional probabilities. The results of this study are expected to be readily expandable and applicable not only to analyst reports, but also to financial field texts such as performance reports, IR reports, press articles, and social media.

Prediction for Nonlinear Time Series Data using Neural Network (신경망을 이용한 비선형 시계열 자료의 예측)

  • We have compared and predicted for non-linear time series data which are real data having different variences using GRCA(1) model and neural network method. In particular, using Korea Composite Stock Price Index rate, mean square errors of prediction are obtained in genaralized random coefficient autoregressive model and neural network method. Neural network method prove to be better in short-term forecasting, however GRCA(1) model perform well in long-term forecasting.

A Study on the stock price prediction and influence factors through NARX neural network optimization (NARX 신경망 최적화를 통한 주가 예측 및 영향 요인에 관한 연구)

  • The stock market is affected by unexpected factors, such as politics, society, and natural disasters, as well as by corporate performance and economic conditions. In recent days, artificial intelligence has become popular, and many researchers have tried to conduct experiments with that. Our study proposes an experiment using not only stock-related data but also other various economic data. We acquired a year's worth of data on stock prices, the percentage of foreigners, interest rates, and exchange rates, and combined them in various ways. Thus, our input data became diversified, and we put the combined input data into a nonlinear autoregressive network with exogenous inputs (NARX) model. With the input data in the NARX model, we analyze and compare them to the original data. As a result, the model exhibits a root mean square error (RMSE) of 0.08 as being the most accurate when we set 10 neurons and two delays with a combination of stock prices and exchange rates from the U.S., China, Europe, and Japan. This study is meaningful in that the exchange rate has the greatest influence on stock prices, lowering the error from RMSE 0.589 when only closing data are used.

  • In terms of generalized autoregressive conditional heteroscedastic(GARCH) model, estimation of prediction interval based on likelihood is quite sensitive to distribution of error. Moveover, it is not an easy job to construct prediction interval for conditional variance. Recent studies show that the bootstrap method can be one of the alternatives for solving the problems. In this paper, we introduced the bootstrap approach proposed by Pascual et al. (2006). We employed it to Korean stock price data set.

Trading Algorithm Selection Using Time-Series Generative Adversarial Networks (TimeGAN을 활용한 트레이딩 알고리즘 선택)

  • A lot of research is being going until this day in order to obtain stable profit in the stock market. Trading algorithms are widely used, accounting for over 80% of the trading volume of the US stock market. Despite a lot of research, there is no trading algorithm that always shows good performance. In other words, there is no guarantee that an algorithm that performed well in the past will perform well in the future. The reason is that there are many factors that affect the stock price and there are uncertainties about the future. Therefore, in this paper, we propose a model using TimeGAN that predicts future returns well and selects algorithms that are expected to have high returns based on past records of the returns of algorithms. We use TimeGAN becasue it is probabilistic, whereas LSTM method predicts future time series data is deterministic. The advantage of TimeGAN probabilistic prediction is that it can reflect uncertainty about the future. As an experimental result, the method proposed in this paper achieves a high return with little volatility and shows superior results compared to many comparison algorithms.
